Harnessing Machine Learning to Predict Air Quality: A Science Buddies Project

Air pollution, particularly in urban areas, is increasing due to increased industrial activity, vehicle fuel consumption, and natural events such as wildfires. The effects of air pollution are far-reaching, impacting public health, ecosystems, and even economies. Air quality is typically measured using the Air Quality Index (AQI), which indicates the level of air pollution and highlights potential health risks to the public. But what if we could go beyond measuring air quality and predict changes in AQI? This foresight could empower communities to take proactive steps to protect vulnerable populations. That’s exactly what this Science Buddies project aims to achieve using machine learning.

The Power of AI and Machine Learning

Artificial Intelligence (AI) is a transformative branch of computer science focused on creating systems capable of solving problems and analyzing information autonomously. Machine learning, a key subset of AI, seeks to develop tools that can learn and improve over time using data. By applying machine learning to air quality prediction, we can uncover patterns in data and generate forecasts that could help communities prepare for air pollution events.

This project introduces students to machine learning models, including Recurrent Neural Networks (RNNs) and Long Short-Term Memory (LSTM) networks. These tools are powerful for analyzing and forecasting time-series data, such as AQI trends.

Understanding RNNs and LSTMs

RNNs are neural networks specifically designed to process sequential data. This makes them highly effective for tasks in which the order of the data matters, such as predicting stock prices, language translation, and time-series forecasting, including AQI predictions. RNNs achieve this by using recurrent connections that allow information to persist, enabling the model to retain context from previous inputs as it processes new data.

However, RNNs have a notable limitation: They struggle with long-term dependencies, often “forgetting” older information as new inputs are introduced. This is where LSTMs excel. LSTMs are a specialized type of RNN that employs mechanisms called “gates” to control information flow. These gates enable LSTMs to selectively remember or forget information, making them particularly adept at handling time-series data that spans long sequences, like AQI patterns over weeks or months.

How This Project Works

In this Science Buddies project, students will:

  1. Collect Air Quality Data: Select a location of interest and retrieve historical AQI data from publicly available sources, such as government air quality monitoring websites or APIs.
  2. Explore the Data: Analyze and visualize the data to identify trends and patterns and understand how AQI changes over time.
  3. Build an LSTM: Using machine learning tools and programming platforms, such as Python with libraries such as TensorFlow or Keras. This model will learn from historical AQI data to predict future air quality levels.
  4. Evaluate and Optimize: Assess the model’s performance and refine parameters to improve accuracy.

Extending the Application: Predicting Weather

Students can apply these methods to other datasets, such as weather data. For example, using resources such as the Florida Automated Weather Network (FAWN), they could collect local weather data and develop a machine-learning model to predict weather patterns. By creating a personalized weather station, students could forecast conditions such as temperature, rainfall, and humidity using local data. This extension provides a hands-on way to explore how machine learning can be applied to various real-world scenarios beyond air quality prediction.

Why This Project Matters

Predicting air quality is not just a technical challenge—it’s a societal imperative. By forecasting AQI levels, communities can:

  • Protect Vulnerable Populations: Warnings enable individuals with respiratory conditions, children, and older adults to take precautions.
  • Inform Policy Decisions: Policymakers can use predictions to implement temporary restrictions, like reducing vehicular traffic on high-pollution days.
  • Raise Awareness: Predictions highlight the importance of air quality issues and encourage sustainable practices.
